ASkDAgger is an interactive imitation learning framework in which the robot "novice" submits its planned action to the human teacher whenever it is uncertain, thereby fully exploiting the information carried by that plan — adaptively adjusting the query gating threshold, reusing novice actions as demonstrations, and replaying experience by priority — so that human annotation effort is substantially reduced while policy performance and generalization improve.
Interactive Imitation Learning (IIL) lets humans provide demonstrations and corrections while the robot is performing a task, and is an effective way to address the covariate shift problem. However, human teaching effort is the core bottleneck for applying IIL at scale.
"Human teaching effort is a significant bottleneck for the broader applicability of interactive imitation learning."
When existing active DAgger methods (such as SafeDAgger and ThriftyDAgger) query the teacher, they simply hand over control and completely discard the novice's planned action. This incurs two losses:
I plan to do this, but I am uncertain."——教师随即对该计划进行验证(validate)、重标注(relabel)或拒绝(reject),并将反馈信息用于三个方面:自适应门控、示范数据集构建、优先回放。ASkDAgger lets the novice say, when it is uncertain: "I plan to do this, but I am uncertain." — the teacher then validates, relabels, or rejects that plan, and the feedback is used in three ways: adaptive gating, demonstration dataset construction, and prioritized replay.
(PIER)。At every time step ASkDAgger lets the novice submit its planned action to the teacher with a certain probability; once the teacher has given feedback, the framework exploits that feedback through three components: adaptively adjusting the query gate (SAG), reusing the plan as a demonstration (FIER), and prioritized replay (PIER).
动态调节查询阈值 γ,以追踪用户指定的度量:sensitivity(真阳性率)、specificity(真阴性率)或最低系统成功率。 Dynamically adjusts the query threshold γ so as to track a user-specified metric: sensitivity (true positive rate), specificity (true negative rate), or a minimum system success rate. A logistic regression over the outcomes of the most recent Nmin queries estimates the expected metric value at the current threshold, which is compared with the target σdes to update the threshold.
· 验证(validate):菜鸟动作本身即为正确示范;
· 重标注(relabel):菜鸟对某目标的失败动作可被标注为另一目标的成功示范(类似 HER);
Once the teacher has validated or relabeled the novice plan, it is added to the demonstration dataset:
· validate: the novice action is itself a correct demonstration;
· relabel: a novice action that fails for one goal can be labeled as a successful demonstration for another goal (similar to HER);
· reject: the novice action is neither valid nor relabelable, so the teacher has to provide a separate demonstration.
P(i, t) ∝ pαi,t,其中 pi,t 综合了不确定性、成功率与年龄三项因素。When demonstrations are replayed, priority is assigned according to three factors: (i) the higher the novice uncertainty, the higher the priority; (ii) demonstrations in which the novice failed take precedence over successful contexts; (iii) the more recently a demonstration was collected, the higher its priority (age). The priority sampling probability is P(i, t) ∝ pαi,t, where pi,t combines uncertainty, success rate, and age.
Formally, ASkDAgger addresses the interactive imitation learning (IIL) problem: the robot novice and the human teacher interact in turn, and the novice learns a mapping from observation o to skill parameters a (that is, a goal-conditioned affordance). At each time step t the novice outputs an action at together with the corresponding uncertainty ut. If the uncertainty exceeds the adaptive threshold γ, a query is issued to the teacher with probability pquery, asking the teacher to evaluate the novice's planned action. The teacher feedback rt indicates whether the action is applicable to the current goal g (success/failure), and is used to update the SAG threshold and the PIER priorities.
SafeDAgger(Zhang & Cho, 2017)使用固定启发式阈值;ThriftyDAgger(Hoque et al., 2022)使用固定查询率;现有主动 DAgger 变体在查询时均放弃菜鸟动作。 SafeDAgger (Zhang & Cho, 2017) uses a fixed heuristic threshold; ThriftyDAgger (Hoque et al., 2022) uses a fixed query rate; all existing active DAgger variants throw away the novice action when they query. ASkDAgger is the first to systematically exploit the information carried by the novice action at query time, gaining on three levels at once (gating, dataset construction, replay).
The paper validates four core claims (C1–C4) on three kinds of experimental platform: MNIST digit classification (validating SAG), CLIPort language-conditioned tabletop manipulation in simulation (validating C1–C3), and real-world robot assembly and sorting tasks (validating the practical applicability of C1–C4).
Under the CLIPort (Shridhar et al., 2021) framework, 10 agents are trained and 300 interactive demonstrations are collected, and on 4 tasks the method is compared with the following baselines: active DAgger (without FIER and PIER), SafeDAgger, ThriftyDAgger, plus the ASkDAgger w/o FIER and ASkDAgger w/o PIER ablations. Hyperparameters: mode = sensitivity, σdes = 0.9, Nmin = 15, prand = 0.2; PIER: α = 1.5, b = 10, β = 1, λ = 0.5.

Summary of the results (from Fig. 5–6 of the paper): on every task the cumulative reward of ASkDAgger matches or exceeds all baselines, while the number of teacher-annotated demonstrations (annotation tuples) required is markedly lower — because ASkDAgger uses a large number of validated and relabeled novice actions directly as demonstrations, which need no additional teacher annotation.
In the three-stage domain transfer setting (150 demonstrations per stage), ASkDAgger (with PIER) compared with ASkDAgger w/o PIER reaches a higher system success rate on all three consecutive tasks — packing-seen-shapes, packing-unseen-shapes, and packing-seen-google-objects-seq — and collects fewer annotation tuples in the later stages (more of them coming from validated demonstrations). SAG maintains the specified sensitivity level throughout training.
An engine assembly task was run on a Franka Panda robot (4 bolt colors × 7 mounting positions, 150 demonstrations): the system success rate stayed at a high level, while as training proceeded the share of validated demonstrations grew and the share of annotated demonstrations fell — showing that in a real setting the novice policy gradually completes the task on its own without human intervention. In addition, a sorting task on a Boston Dynamics Spot robot demonstrated the ability of ASkDAgger to integrate with built-in primitive skills.
The ablation study (Fig. 8) shows that removing FIER (ASkDAgger w/o FIER) clearly degrades performance on the unseen task suites, because the route to obtaining demonstrations for unseen scenarios through relabeling is lost; removing PIER (ASkDAgger w/o PIER) slows down adaptation during domain transfer and requires more annotations. Neither component can be dispensed with.
"ASkDAgger is designed for tasks with sparse rewards and learning mid- to high-level control. While this covers many problems, it does not extend to applications requiring high-rate feedback from the teacher." ASkDAgger is designed for tasks with sparse rewards and learning mid- to high-level control. While this covers many problems, it does not extend to applications requiring high-rate feedback from the teacher." ASkDAgger is therefore best suited to settings in which the robot already has predefined primitive skills and has to learn skill selection and parameterization, whereas for low-level control tasks that need continuous high-rate feedback its applicability is limited.
"FIER significantly improves performance, it relies on recasting failures as successes, which can be challenging in some applications." FIER significantly improves performance, it relies on recasting failures as successes, which can be challenging in some applications." If the task structure does not allow one action to correspond to several goals (for instance when the action space lacks overlap), the advantage of FIER is greatly diminished.
"ASkDAgger assumes the teacher can validate or relabel actions before execution. This may not always be feasible." ASkDAgger assumes the teacher can validate or relabel actions before execution. This may not always be feasible." In settings with extremely tight real-time requirements, or where the teacher cannot conveniently intervene online, pre-execution feedback may be infeasible. The authors note that in such cases validation and relabeling can be carried out post-execution, but this affects the interaction flow.
"Tuning hyperparameters in real-world settings is challenging. However, our experiments show that a single set of hyperparameters, without extensive tuning, generalizes effectively across different tasks, suggesting that hyperparameter sensitivity is not strongly dependent on task descriptions." Tuning hyperparameters in real-world settings is challenging. However, our experiments show that a single set of hyperparameters, without extensive tuning, generalizes effectively across different tasks, suggesting that hyperparameter sensitivity is not strongly dependent on task descriptions." The authors point out that the problem exists, but also provide evidence that it is mitigated.
"Our evaluations primarily used policies with a CLIPort architecture, but ASkDAgger is not limited to this choice. It can be applied to any policy architecture where a teacher can determine the success of actions and provide demonstrations." Our evaluations primarily used policies with a CLIPort architecture, but ASkDAgger is not limited to this choice. It can be applied to any policy architecture where a teacher can determine the success of actions and provide demonstrations." ASkDAgger is architecture-agnostic in principle, but empirical validation on other policy architectures (diffusion policies, Transformers and so on) is still insufficient.
